# Advanced Features (2026 Update)

## Overview

This document describes the advanced features added in 2026 to the Housing Price Prediction Dataset project.

## New Advanced Scripts

### 1. Advanced ML Models (`advanced_models.py`)

Comprehensive machine learning framework with multiple algorithms:

- **Linear Models**: Linear Regression, Ridge, Lasso, Elastic Net
- **Tree-based Models**: Decision Tree, Random Forest, Gradient Boosting, AdaBoost
- **Advanced Models**: XGBoost, LightGBM (optional dependencies)
- **SVR**: Support Vector Regression

**Features:**
- Automatic feature engineering
- Cross-validation with configurable folds
- Comprehensive metrics (RMSE, R², MAE, MAPE)
- Model comparison and ranking
- Model persistence (saves all trained models)
- Feature importance analysis

**Usage:**
```bash
python advanced_models.py
```

**Output:**
- Trained models saved to `models/` directory
- Performance comparison table
- Feature importance rankings

### 2. Feature Engineering (`feature_engineering.py`)

Advanced feature creation and preprocessing:

**Feature Engineering:**
- Age features (house age, years since renovation)
- Size ratios (basement ratio, lot ratio, etc.)
- Room ratios (bedroom/bathroom ratio, sqft per room)
- Quality scores (grade × condition)
- Location normalization
- Comparative features (vs. neighbors)
- Interaction features

**Preprocessing:**
- Outlier removal (IQR or Z-score method)
- Feature scaling (Standard, Robust, MinMax)
- PCA (Principal Component Analysis)
- Correlation analysis

**Usage:**
```bash
python feature_engineering.py
```

**Output:**
- Engineered dataset: `housing_prices_engineered.csv`
- Correlation analysis report
- Feature list

### 3. Hyperparameter Tuning (`hyperparameter_tuning.py`)

Optimize model performance with hyperparameter tuning:

**Methods:**
- Grid Search (exhaustive search)
- Randomized Search (faster, good for large spaces)

**Supported Models:**
- Random Forest
- Gradient Boosting
- XGBoost (if available)

**Usage:**
```bash
python hyperparameter_tuning.py
```

**Output:**
- Best hyperparameters for each model
- Tuned models saved to `tuned_models/` directory
- Best parameters saved as JSON

### 4. Model Comparison (`model_comparison.py`)

Compare multiple models with visualization:

**Features:**
- Cross-validation comparison
- Performance metrics visualization
- Model ranking charts
- Statistical comparison

**Visualizations:**
- RMSE comparison (bar charts)
- R² score comparison
- Model ranking plots
- Error bars showing standard deviation

**Usage:**
```bash
python model_comparison.py
```

**Output:**
- Comparison plots in `plots/` directory
- Performance summary table

### 5. Price Prediction (`predict_price.py`)

Easy-to-use price prediction utility:

**Features:**
- Load trained models or train default model
- Predict price for single property
- Batch prediction for multiple properties
- Example usage included

**Usage:**
```python
from predict_price import HousingPricePredictor

predictor = HousingPricePredictor()
property_data = {
'bedrooms': 3,
'bathrooms': 2,
'sqft_living': 2000,
# ... other features
}
price = predictor.predict(property_data)
print(f"Predicted Price: ${price:,.2f}")
```

## Installation of Advanced Dependencies

To use all advanced features, install optional dependencies:

```bash
pip install xgboost lightgbm scipy tqdm
```

Or install all requirements:
```bash
pip install -r requirements.txt
```

## Workflow Example

1. **Explore and Validate Data:**
```bash
python validate_data.py
python data_analysis.py
```

2. **Advanced Feature Engineering:**
```bash
python feature_engineering.py
```

3. **Train Advanced Models:**
```bash
python advanced_models.py
```

4. **Tune Hyperparameters:**
```bash
python hyperparameter_tuning.py
```

5. **Compare Models:**
```bash
python model_comparison.py
```

6. **Make Predictions:**
```bash
python predict_price.py
```

## Performance Improvements

With the new advanced features, you can achieve:
- Better model accuracy with hyperparameter tuning
- More robust models with advanced algorithms
- Better feature representation with engineering
- Comprehensive evaluation with comparison tools

## Model Persistence

All trained models are automatically saved:
- `models/` - Standard trained models
- `tuned_models/` - Hyperparameter-tuned models
- Models can be loaded and used for predictions

## Future Enhancements

Potential additions for future updates:
- Deep Learning models (Neural Networks)
- Automated ML (AutoML)
- Model deployment API
- Real-time prediction service
- Advanced ensemble methods
